Optimizing Agricultural Yield and Population Forecasting Using Machine Learning Techniques

Introduction

Project Overview

This report combines three distinct projects focusing on predictive modeling using regression and decision tree techniques: optimizing agricultural yield, analyzing world population growth, and predicting global population trends using random forest regression. The combined efforts aim to address challenges in agriculture and population forecasting, providing valuable insights for sustainable development and policy-making.

Personal Motivation

Driven by a passion for uncovering actionable insights and solving real-world problems through data science, I embarked on these projects to explore the potential of machine learning in agriculture and demographic analysis. My background in data science and software engineering, bolstered by the ExploreAI data science and Holberton software engineering programs, provided the foundation to tackle these challenges effectively.

Methodology

Data Collection and Preparation

Agricultural Yield

  • Dataset Source: ExploreAI Academy.
  • Data Handling: Addressed missing values through imputation, encoded categorical variables, and standardized numerical features.

Population Growth Analysis

  • Dataset Source: ExploreAI Academy, including population statistics from 1960 to 2017.
  • Data Handling: Imputed missing population data using linear interpolation and normalized features where necessary.

World Population Prediction by Income Groups

  • Dataset Source: ExploreAI Academy, including population data and metadata categorizing countries by income groups.
  • Data Handling: Filtered data by income group, handled missing values, and engineered features to ensure consistency in model inputs.

Exploratory Data Analysis (EDA)

Agricultural Yield

  • Insights: Identified significant impacts of temperature and rainfall on yield through visualizations such as histograms and scatter plots.

Population Growth

  • Insights: Detected varying growth patterns and anomalies using line plots, bar charts, and heatmaps.

World Population Prediction

  • Insights: Observed growth trends across income groups, highlighting disparities through line plots and anomaly detection.

Modeling and Implementation

Model Selection

Agricultural Yield

  • Models Considered: Multiple linear regression (MLR), Ridge regression, Lasso regression, and decision trees.
  • Final Models: MLR enhanced with interaction terms and polynomial features, regularization techniques, and decision trees.

Population Growth Analysis

  • Models Considered: Linear regression, random forests, decision trees.
  • Final Model: Decision Tree Regression for its balance of interpretability and ability to model complex relationships.

World Population Prediction

  • Models Considered: Linear regression, decision trees, random forest regression.
  • Final Model: Random forest regression for its robustness and accuracy in capturing population trends.

Implementation Details

Agricultural Yield

  • Libraries: scikit-learn for model implementation.
  • Key Techniques: Standardization, cross-validation using RidgeCV and LassoCV, and DecisionTreeRegressor for handling categorical and numerical data.

Population Growth Analysis

  • Libraries: Pandas, NumPy, scikit-learn.
  • Key Techniques: Data preprocessing, population growth calculation, feature and response split, and decision tree training and evaluation.

World Population Prediction

  • Libraries: Pandas, NumPy, scikit-learn.
  • Key Techniques: Data integration, cross-validation, hyperparameter tuning, and random forest training and evaluation.

Results and Evaluation

Model Performance

Agricultural Yield

  • Metrics: R-squared, mean squared error (MSE), and root mean squared error (RMSE). Ridge regression achieved an RMSE of 0.0881.

Population Growth Analysis

  • Metrics: Root Mean Squared Logarithmic Error (RMSLE) with a testing RMSLE of 0.008.

World Population Prediction

  • Metrics: Mean Squared Error (MSE). Random forest regression achieved the lowest MSE across cross-validation splits.

Population Growth Analysis

  • Implications: Informs policy-making, economic planning, and resource allocation based on accurate demographic forecasts.
